Anomaly Detection

Definition

Automated identification of unusual changes in spend, sales, traffic, conversion, or other campaign metrics.

Overview

Anomaly Detection Automated identification of unusual changes in spend, sales, traffic, conversion, or other campaign metrics. False positives — normal variation flagged as abnormal — are the most common operational problem and erode trust unless actively managed.

False positives cause alert fatigue: operations teams begin ignoring notifications, and real problems can slip by. Reducing false positives requires combining sensible modeling choices with business-aware signal handling and human-in-the-loop feedback. The goal is to ensure alerts are actionable and contextualized, not merely statistically significant.

Common Causes Of False Positives

  • Unmodeled Seasonality: Daily/weekly cycles and promotional calendars create large, predictable swings that naive detectors misflag.
  • Holidays And Promotions: One-off events change behavior dramatically and must be annotated or masked.
  • Data Issues: Missing data, late-arriving events, and tracking tag failures look like drops or spikes.
  • Metric Mixing: Combining incompatible dimensions (e.g., sessions and users) in a single detector increases noise.

Techniques To Reduce False Alerts

Implement these techniques together — each reduces a different false-positive source.

  • Seasonal Decomposition: Remove weekly and yearly seasonality before anomaly scoring so expected patterns aren’t flagged.
  • Holiday & Promo Calendars: Apply suppression windows or special models for known events (Black Friday, product launches).
  • Multiple Model Ensemble: Require agreement between models (statistical + ML) before escalating an alert to humans.
  • Contextual Filters: Suppress alerts for low-volume segments (e.g., campaigns with < X impressions) to avoid noise.
  • Adaptive Thresholds: Use percentiles or quantile-based thresholds rather than fixed z-scores when variance changes over time.
  • Investigation Playbooks: Include next-step checks (data ingestion status, tag coverage, recent bid changes) with each alert—reduce manual triage time.

Designing Alert Prioritization And Routing

Triage matters. Not every anomaly needs a page or an immediate Slack ping. Implement alert severities matched to impact, and route high-priority incidents (e.g., billing spikes, site-wide conversion collapse) to on-call engineers while lower-priority anomalies go to analytics queues.

  • Impact Scoring: Multiply anomaly magnitude by revenue exposure (daily spend or expected conversions) to prioritize.
  • Automated Remediation: For some alerts, trigger safe automated actions (pause a campaign, throttle bids) with human approval workflows.
  • Escalation Windows: Require an anomaly to persist across multiple intervals before paging on-call.

Human Feedback And Continuous Improvement

Feed analyst judgments back into the system. Mark alerts as true/false positives and use that history to tune thresholds, retrain models, or add suppression rules. Over time, a supervised layer built from labeled analyst responses can dramatically cut false alarms.

Practical Example

Marketing ops runs a layered detector on daily ad spend. A seasonal baseline flags a 40% drop on a Monday after a holiday weekend. An ML detector signals no anomaly because multivariate context (clicks, conversions) moved proportionally. The system suppresses the alert, logs the event against the holiday calendar, and adds a low-priority ticket to the analytics queue. If the drop persists for three days or revenue impact exceeds a predefined threshold, the system escalates to a Slack alert.

In short, the Anomaly Detection program that minimizes false positives mixes robust preprocessing (seasonality and holiday handling), conservative alerting logic (ensembles and persistence), business-aware prioritization, and a feedback loop that converts analyst decisions into model improvements.
